How do you take care of peonies after the flowers die?

What do you do with the stems left on peony plants after the flowers die? Wasn't sure if I should cut them off or leave them because there are clusters of bud-like growth on the ends of stems

The budlike growths that you see are developing seedpods. It's a good idea to cut them off back to the first set of leaves to prevent the plant from expending unecessary energy on maturing the seeds.
